Summary

Integrates confidence-guided verification with the embedded DeepSeek-V4 DSpark runtime, distributed scheduling and CUDA graphs. The drafter still produces the full physical K proposals; confidence selects how many proposal rows the target verifies. Target acceptance, request ownership and the existing attention backend are unchanged.

PR4 #20071 is merged. This draft is stacked on the current PR5 #20072 implementation and remains dependent on PR5. GitHub's main-targeted diff includes that unmerged dependency; the remaining integration slice is reviewed separately. PR6 will stay draft while that dependency and native integration validation remain outstanding.

Configuration and execution

  • Confidence scheduling remains default-off. Explicitly enabling it requires trained confidence weights, a measured physical-K cost table covering the configured graph ladder, and calibration when used by the head.
  • Existing structurally valid artifacts can be reused by default. Their original provenance is preserved; the runtime warns that freshness and positive performance economics are unverified. Reuse does not create an admission receipt or alter target acceptance. Schema, finite positive measurements, physical K, exact graph/layout coverage and legal verification windows remain mandatory.
  • validate_confidence_artifact_freshness=True opts into matching live-fingerprint and positive workload-admission checks. Missing or invalid strict admission resolves to feature-off native execution before engines and workers are constructed.
  • The optional fused selector/layout path is independently default-off. Persistent buffers preserve graph addresses; unsupported optional shapes and supported synchronous dispatch failures retain the tensor selector. Numerical thresholds and unrelated error checks are unchanged.
  • Enabled scheduling requires padded graphs and PP1. Standalone DSpark, guided decoding, LoRA and incompatible sparse top-k configurations remain unsupported. Per-request logits post-processors and advanced rejection draft sampling are rejected before activation; greedy requests and rejection-disabled sampling retain their existing behavior. The decoder also checks the group-uniform sampler decision before graph lookup.
  • Decode-only groups retain rank-agreed padded graphs. confidence_mixed_evidence=None leaves mixed verification native without disabling enabled decode-only scheduling. Optional mixed scheduling requires its own measured evidence; decode cost cells are not repurposed as mixed costs and reuse does not relax the mixed contract.

The supported mixed route is embedded physical K3, TP8/PP1/CP1, attention DP, greedy sampling and captured BREAKABLE body buckets. Only current generation owners can receive shorter prefixes. Context, bootstrap and padding rows remain reserved; first context chunks, stale owners and unsupported or uncovered geometry retain native width. Host-authoritative lengths reach attention preparation without changing the backend or acceptance rule.

The measured-cost selector retains its immediate predicted-goodput margin and any supplied drain guard. A reused table without optional drain metadata selects by immediate goodput alone; strict validation retains native verification. Neither behavior guarantees an end-to-end gain. Mixed pricing remains a rank-0 forward proxy, and mixed admission must charge the opt-in overhead on every policy step.

The DeepSeek-V4 README explains K/G/V, artifact reuse, optional strict admission, mixed-route limits and drafter fusion scope. This PR consumes measured artifacts; public self-generation tooling and a validated clean-checkout reproduction procedure are separate work, not delivered by these configuration fields.

Migration from earlier draft revisions

For enabled configurations using an earlier revision of this draft that must retain its strict admission behavior, set validate_confidence_artifact_freshness=True. Confidence remains default-off; confidence-disabled execution is unchanged. These confidence-activation controls are new to main.

Review corrections

  • Embedded V4/V4.1 checkpoint loading validates the complete confidence-head namespace before the shared parameter walk. Unknown keys, missing weights and incompatible shapes are rejected; valid biased and bias-free checkpoints retain their tensor-copy and RNG behavior.
  • Draft stamps wrap within the supported int32 range, neutralizing persistent confidence rows at the wrap boundary without replacing graph storage.
  • CPU slot fixtures now replace all CUDA allocation constructors and initialize the host ownership fields used by the real worker. All slot-preservation assertions remain intact.

Validation

Focused checks use real CPU PyTorch, complete pure planner/selector modules and exact selected configuration, loader, worker and executor methods. They cover artifact structure and reuse, strict admission, embedded checkpoint validation, request-local rejection before activation, sampler-group decisions, stamp wrap and both padding families. Original/fixed/restored controls reproduce the embedded-loader, stamp-overflow and CPU-fixture failures.

The local Windows harness bypasses unavailable native package initialization and uses simulated host peer exchanges. It does not establish native imports, MPI collectives, CUDA graph replay, full-model accuracy or performance. Newly touched CPU-only tests carry explicit CPU markers and are selected by the existing l0_cpu.yml parent subtree. Existing GPU tests remain GPU tests.

The actual telemetry projector emits only the new public freshness boolean; inherited manifest rows are preserved. The unmodified full manifest generator was attempted but stopped before configuration import because the local CPU environment lacks nvtx. A configured-Linux full TorchLlmArgs/golden-generator check, telemetry/privacy CODEOWNER review, exact-tip native integration and repository CI remain pending. No earlier private numerical or performance result qualifies this composed tip.

PR Checklist

  • Scope, defaults, dependency and remaining validation are stated above.

  • Tests preserve assertions, numerical thresholds, scanning and native feature-off behavior.

  • Runtime, distributed scheduling, CUDA graph, request/KV/sampling and telemetry owners should review their affected contracts.

  • Please check this after reviewing the above items as appropriate for this PR.

Walkthrough

This change adds opt-in DSpark confidence-based verification scheduling, including device and host window-selection paths and distributed graph handling. It also adds evidence-based admission controls and expands fused attention support to physical draft blocks from K=1 through K=8.

Changes

DSpark confidence scheduling

Layer / File(s) Summary
Confidence scheduling configuration and admission
tensorrt_llm/llmapi/llm_args.py, tensorrt_llm/usage/llm_args_golden_manifest.json, examples/models/core/deepseek_v4/README.md, tests/unittest/llmapi/*, tests/unittest/_torch/speculative/hw_agnostic/test_dspark_admission_resolution.py, tests/integration/test_lists/test-db/l0_cpu.yml
Adds opt-in scheduling settings and workload-admission checks. Missing, invalid, or non-positive admission evidence clears confidence settings. Physical K=1 also clears confidence inputs.
Full-block confidence signals and calibration
tensorrt_llm/_torch/models/modeling_dspark.py, tensorrt_llm/_torch/models/modeling_speculative.py, tensorrt_llm/_torch/speculative/dspark.py, tensorrt_llm/_torch/speculative/dspark_sts.py, tensorrt_llm/_torch/speculative/dspark_verify.py, tests/unittest/_torch/speculative/hw_agnostic/test_dspark_{draft,heads,sts,worker,confidence_routing}.py
Draft calls continue to propose the full block and can return fixed-shape confidence logits. Confidence heads support STS calibration; the worker stores slot-indexed confidence scores and stamps.
Device window selection and ragged execution
tensorrt_llm/_torch/speculative/dspark_{schedule,device_select}.py, tensorrt_llm/_torch/speculative/interface.py, tensorrt_llm/_torch/pyexecutor/engine/metadata.py, tensorrt_llm/_torch/pyexecutor/engine/runners/decoder/runner.py, tests/unittest/_torch/speculative/*device*, tests/unittest/_torch/speculative/hw_agnostic/test_dspark_schedule_fused.py
Adds per-request window selection, compact-layout materialization, and ragged metadata and token handling. Fused scheduling falls back to tensor scheduling when its runtime path fails.
Distributed graph agreement and executor wiring
tensorrt_llm/_torch/pyexecutor/{cuda_graph_runner.py,py_executor.py,model_engine.py,_util.py}, tensorrt_llm/_torch/pyexecutor/engine/runners/decoder/runner.py, tests/unittest/_torch/executor/*, tests/unittest/_torch/speculative/hw_agnostic/test_dspark_{cuda_graph_runtime,executor_policy,model_engine_runtime,dummy_slots_cpu,worker}.py
Coordinates exact-SPS decisions and graph shapes across ranks. Adds ragged graph keys, shape agreements, two padding-dummy variants, and engine accessors for decoder-owned state.
Authenticated mixed host scheduling
tensorrt_llm/_torch/speculative/dspark_mixed_evidence.py, tensorrt_llm/_torch/pyexecutor/dspark_mixed_*.py, tensorrt_llm/_torch/pyexecutor/engine/runners/decoder/runner.py, tensorrt_llm/_torch/pyexecutor/py_executor.py, examples/models/core/deepseek_v4/README.md, tests/unittest/_torch/speculative/hw_agnostic/test_dspark_mixed_*.py
Adds mixed-cost evidence validation, authenticated host snapshots, capacity candidates, and distributed host-window selection. Unsupported routes or uncovered evidence retain native mixed verification.
Physical draft blocks K=1 through K=8
tensorrt_llm/_torch/custom_ops/dspark_*_custom_op.py, tensorrt_llm/_torch/cute_dsl_kernels/blackwell/dspark/attention.py, tests/unittest/_torch/speculative/test_dspark_cute_dsl_attention.py, tests/unittest/_torch/speculative/hw_agnostic/test_dspark_fused_attention_route.py, examples/models/core/deepseek_v4/README.md

Confidence scheduling is opt-in, but when it is enabled, distributed ranks can disagree on graph shapes and hang. A request that uses a logits post-processor can also fail a whole batch. A CPU CI test is likely to fail. Fix these before merging.

Restore the kernel cache after the shared-scratch test.

This test clears _dspark_attention_kernel_cache and leaves eight compiled entries in it. test_self_jit_reuses_one_kernel_across_runtime_shapes_and_scales clears the cache before it runs, so test order does not cause a failure now. Other tests in the module do not reset the cache. Those tests can see a hot cache depending on order, so a cache-miss path can go untested. Use a fixture that saves the cache and restores it on teardown.

Coverage summary: the reference, graph-replay, batched-fallback, self-JIT, and capture-rejection tests are parameterized over K=1..8. The changes add zero-length scratch-row cases and use nonzero draft padding to check masking. These tests need SM100/SM103 GPUs. The l0_* lists do not show which GPU list runs this file. Verdict: needs follow-up.

Mark this module as CPU-only.

The file is collected by both l0_cpu.yml and the broad l0_h100.yml subtree. It does not load CUDA or GPU runtimes, and neighboring hardware-agnostic CPU tests use pytest.mark.cpu_only. Add the module marker so the H100 not cpu_only selection does not schedule this test there.

3894-3931: 🎯 Functional Correctness | 🔵 Trivial | 🏗️ Heavy lift

Add direct tests for _dspark_confidence_draft_len orchestration.

The new tests cover the wire helpers, _can_queue reuse, and _handle_dynamic_draft_len with this function mocked. No test runs _dspark_confidence_draft_len itself. These behaviors are untested:

  • When agreement.can_queue is false, the function clears agreed_ragged_bucket, ragged_pad_verify_len, ragged_zero_real_high_rows, and every py_verify_len.
  • When mixed.apply returns True, the function replaces the agreement with all_can_graph=False, ragged_bucket=None, and reuse_graph_shape=False, then stages confidence.
  • When there is no exact allocation (selected_verifier_budget == 0 or the secondary dummy is not ready), stale py_verify_len values must be cleared.
  • When reuse_graph_shape is true and the exact G differs from common_padded_batch_size, the function must raise.

A regression in any of these can replay a stale ragged bucket or a rank-local full graph. That can desynchronize ADP collectives.

Smallest practical test: in tests/unittest/_torch/speculative/hw_agnostic/test_dspark_executor_policy.py, build a PyExecutor.__new__ stub. Give it a fake planner, a fake runner, and dist.tp_allgather_int64 returning crafted payloads. Assert the runner state and py_verify_len for the can_queue=False case and the mixed-apply case.

As per path instructions: "Leave an INLINE review comment on the smallest relevant changed production-code hunk when a material test coverage gap exists."

Use the live iteration when validating cached ADP agreements.

CUDAGraphRunner.maybe_get_cuda_graph and _get_padded_batch pass agreement.iteration to ADPShapeAgreement.matches, so the iteration comparison is always true. A stale agreement can therefore be accepted when a new ScheduledRequests object has the same id() and batch size. One rank may skip the tp_allgather_int64 collective while another rank enters it, which can hang the step.

Pass the executor's live iteration counter to both methods. Clear adp_shape_agreement after the step consumes it so the agreement cannot be reused accidentally.

Reject logits post-processors before ragged verification.

When confidence scheduling selects a ragged window for a generation request with py_logits_post_processors, _forward_step completes the model forward or graph replay and then calls _execute_logit_post_processors. The helper raises RuntimeError, which can abort the entire scheduled step instead of isolating the request.

Reject this combination before scheduling, or disable ragged verification for the whole batch before the forward. Do not clear only one request's py_verify_len unless the resulting batch remains on a uniform layout.

🩺 Stability & Availability | 🟡 Minor | ⚡ Quick win

Wrap the draft-sequence counter before it overflows int32.

_draft_seq_host is an unbounded Python int. _draft_seq_cuda and _confidence_stamp are torch.int32. After 2^31 − 1 steps, self._draft_seq_cuda.fill_(self._draft_seq_host) fails with an overflow error. A long-running confidence-enabled server then crashes on its host path.

The stamp is used only for an equality check (stamp != expected_stamp), so a wrapped counter keeps the same semantics. Wrap the host value inside the int32 range. Keep 0 out of the cycle, because 0 is the initial stamp value.

🐛 Proposed fix
         prev = self._draft_seq_host
- self._draft_seq_host += 1
+ # Stamps are int32 and compared only for equality; wrap before overflow.
+ self._draft_seq_host = self._draft_seq_host % (2**31 - 1) + 1
         if self._draft_seq_cuda is not None:
             self._draft_seq_cuda.fill_(self._draft_seq_host)
         return prev

The device expression self._draft_seq_cuda - 1 in verified_draft_seq_cuda must agree with the wrap. With the fix above it does agree on every step except the step right after a wrap. On that step the stamped row reads as stale and falls back to the neutral row, which is fail-safe.

Update bump_draft_seq to wrap _draft_seq_host within the positive int32 range
before filling _draft_seq_cuda, keeping 0 out of the cycle. Preserve returning
the previous sequence value and the existing equality-based stamp semantics.

Patch all CUDA allocations in the CPU test.

l0_cpu.yml collects this test subtree. _lazy_init allocates _output_verify_lens with torch.empty(..., device="cuda") and _batch_to_slot with torch.full(..., device="cuda"). Patching only torch.zeros leaves these allocations on CUDA, so the test can fail before its assertions run on a CPU runner.

Update the CPU allocation patches in the test around DSv4DSparkWorker._lazy_init
to also route torch.empty and torch.full allocations to CPU, alongside
torch.zeros, so CUDA-only allocations created during initialization work on CPU
