Dev Engineer Review

The change adds GB300-specific Qwen3.8-Flash-Next NVFP4 modeling_v2 paths for STP and MTP3. The main performance-sensitive areas are sparse GQA attention, GDN replay and recurrence, FP8/NVFP4 GEMV, hyper-connection kernels, MoE tactics, and speculative rollback. The target-specific kernels remain under the model target directory; shared changes add greedy argmax, model opt-in to speculative fast paths, and GDN cached replay commit behavior.

The expanded dispatch and kernel variants increase the need to verify dtype, layout, row-count, and launch-path boundaries. In particular, verify grouped versus per-row attention routing, bf16 versus fp32 recurrent pools, NVFP4 cache handling, fused rollback, and opt-in projection paths. The performance results reported in the PR objectives include changes no longer present after rebase, so they do not isolate the performance effect of this change.

The supplied evidence reports 693 target-op tests passed and 2 skipped, accuracy coverage including test_mtp3_cutedsl_fp8_kv_bf16_state, and 23 passed cases for speculative/test_greedy_argmax.py. The perf-sanity run recorded local results, but its pytest verdict was not captured after server teardown ended the Slurm step. Seventeen speculative/test_eagle3.py cases could not run because required checkpoints were missing. Review severity counts are unavailable.

QA Engineer Review

The change adds or modifies extensive CUDA unit coverage for the target’s attention, GEMM, hyper-connection, MoE, PLE, SSM, rollback, context grouping, and speculative decoding paths. It also adds tests/unittest/_torch/speculative/test_greedy_argmax.py and updates tests/integration/test_lists/test-db/l0_b200.yml to include it.

The target MTP3 perf-sanity case is listed in tests/integration/test_lists/test-db/l0_gb300_multi_gpus_perf_sanity.yml as aggr_upload-gb300_qwen3_8_flash_next_fp4_grace_blackwell-qwen3_8_flash_next_fp4_mv2_tp1_mtp3_8k1k with a 35-minute timeout. The relevant target-specific perf case was not found in the manual-QA lists. The B200 CI list includes the greedy-argmax unit test. The reported perf-sanity run does not establish a pytest pass.

Coverage verdict: needs follow-up. Confirm the perf-sanity pytest result and run the blocked EAGLE3 cases when checkpoints are available.

Description

GB300 performance work on the qwen3_8_flash_next_nvfp4__sm_103__tp1 modeling_v2 target (Qwen3.8-Flash-Next NVFP4, added in #20143 / #20276). It covers the whole Pareto curve at ISL 8192 / OSL 1024 on one GB300 (TP1), with NVFP4 KV cache and bf16 SSM state, for STP and MTP3. The code follows the Modeling V2 guide (#21390): model-specific code, including a forked MoE kernel, stays in the target directory. Two small commits touch shared code; they are listed below.

Results

Measured on 1× GB300 at ISL 8K / OSL 1K. Columns are concurrency. con1 is tok/s/user; the other columns are tok/s/GPU.

curve con1 con2 con4 con8 con16 con32 con64 con128 con256
STP 445 697 1,156 1,733 2,417 3,378 4,580 6,037 7,448
MTP3 857 1,305 1,875 2,751 4,551 5,552 7,132 8,675 10,148

How these were measured:

  • The table is the full sweep on the pre-rebase branch.
  • The MTP3 rows use a forced acceptance of 3.3 tokens/step. Accuracy and real acceptance are measured separately (see Test Coverage).
  • Opt-in configuration used:
    • STP and MTP3: TRTLLM_MODELING_V2_DENSE_FP8=1, TRTLLM_MODELING_V2_GDN_INPROJ_NVFP4=1, the breakable prefill graph with prefill capture buckets up to 16K tokens.
    • STP adds TRTLLM_MODELING_V2_MOE_GEMV=1, a switch since removed (see Moved out of this PR).
    • MTP3 adds TRTLLM_MODELING_V2_MTP_MOE_NVFP4=1 and TRTLLM_MODELING_V2_MTP_HEAD_NVFP4=1.
  • These numbers, including the rebased column below, were measured with changes that are no longer in this PR: three runtime changes (the steady-state verify prepare fast path, TLLM_WORKER_USE_MP_PROCESS=1, and a single cache refresh after the speculative KV-length correction) and a few target kernels. See Moved out of this PR for what each was measured to contribute.

Key points versus the starting point (NVFP4 KV + bf16 state, before this work), and after rebasing onto this main:

key point STP before → after MTP3 before → after rebased on main (STP / MTP3)
con1 tok/s/user 349 → 451 (+29%) 425 → 857 (+102%) 451 / 857
con32 tok/s/GPU 2,907 → 3,378 (+16%) 3,570 → 5,552 (+56%) 3,311 / 5,417
con256 tok/s/GPU 5,986 → 7,448 (+24%) 4,957 → 10,148 (+105%) 7,351 / 10,164

The rebased branch was A/B-tested on one node against the pre-rebase branch:

  • STP: within noise.
  • MTP3: +0.6% at con1, +3.5% at con32 and +1.8% at con256.

What changes

Decode at small batch

  • Hyper-connection site kernels:
    • Faster 1-row sites.
    • 2..16-row sites on a tensor-core launch pair, with the MoE finalize folded in.
    • tc_first extended up to 256 rows.
  • FP8 W8A16 GEMVs (fp8_gemv):
    • Used for dense projections under dense FP8, the vocab head, and the 1-row output and shared-expert projections.
    • Row ranges retuned.
  • GDN:
    • The in_proj GEMV with a fused conv1d epilogue, for 2..16 verify rows and up to 8 decode rows.
    • Decode rows with TMA state staging, and a copy-free cached replay.
    • Opt-in NVFP4 in_proj for up to 8 rows.
  • NVFP4 sparse GQA decode:
    • A CuTe split-K + merge kernel.
    • A fused decode prologue over NVFP4 KV that also covers verify steps.
  • MoE:
    • Pinned trtllm-gen tactics for the decode buckets, which removes start-to-start variance from tactic selection. A tactic that this build's runner does not list as valid falls back to the AutoTuner, with a warning.

MTP

  • Draft step:
    • Runs on the trunk's fused machinery, carries only the draft loop's rows, and computes the sparse query side for the kept rows only.
    • FP8 lm_head copy for the draft head; opt-in NVFP4 draft head and NVFP4 draft-layer experts.
  • Verify:
    • Request-grouped NVFP4 sparse GQA with a coalesced gated epilogue, a split last wave and a per-row merge.
    • Every reachable launch plan is compiled up front.
    • GDN cached-replay verify on a CuTe tensor-core kernel.
  • Rollback and PLE: batched rollback of the QSA index planes; fused PLE on verify and mixed steps.
  • Speculative fast paths: the target opts into the engine's one-engine speculative fast paths from main: the draft loop's step-0 epilogue, the recorded steady decode-step prepare and the overlap loop on the execution stream.

Prefill / mixed steps

  • MoE and dense projections:
    • Faster prefill CuteDSL MoE, with FC2 on the target's own copy of the finalize-fused grouped GEMM (kernels/moe/): an MMA K tile of 128, a row-owned epilogue and L2 cache hints.
    • Opt-in per-tensor FP8 dense projections.
    • tcgen05 dense projections for 17..256 rows (mid_rows_mm).
  • HC and GDN:
    • HC sites without a stored normed stream.
    • A leaner GDN prefill block.
  • Sparse attention row-tile pass: a persistent pass with no per-step Triton recompiles.
  • NVFP4 KV context pass: the bf16 scratch that the row-tile pass reads is filled and attended for a group of consecutive context requests at a time, within 128 MB (_NVFP4_CONTEXT_SCRATCH_BYTES). Before, it held every context request's full history at once. A request whose history alone is larger than 128 MB forms a group of its own.
  • PLE table: kept in host memory on the GPU's NUMA node, from NVML's CPU affinity (get_numa_aware_cpu_affinity).

Shared code outside the target directory

  • speculative/greedy_argmax.py (new, Triton): the greedy target and draft tokens of one-model speculative decoding, at main's two plain-argmax sites. It equals torch.argmax element for element.
  • pyexecutor/model_engine.py:
    • The engine reads spec_decode_fast_paths from any language model, not only from SpecDecOneEngineForCausalLM.
    • A model that builds its own speculative branch, as Modeling V2 targets do, opts in by setting it.

Commits

Four commits: the first two touch shared code only, each with its tests; the third is the target; the fourth updates its perf-sanity case.

  1. [perf] Triton greedy argmax for one-model speculative decoding (the test is added to l0_b200.yml)
  2. [feat] Let a model with its own speculative branch opt into the one-engine speculative fast paths (about 10 lines, with a CPU test)
  3. [perf] Qwen3.8-Flash-Next NVFP4 target: GB300 Pareto optimizations for ISL 8K / OSL 1K (the target-local ops and kernels, their tests, and the target wiring)
  4. [test] Qwen3.8-Flash-Next GB300 perf sanity on the target's fastest MTP3 configuration:
    • File: tests/scripts/perf-sanity/aggregated/gb300_qwen3_8_flash_next_fp4_grace_blackwell.yaml.
    • NVFP4 KV cache with a bf16 recurrent state.
    • The four opt-in switches: TRTLLM_MODELING_V2_DENSE_FP8, TRTLLM_MODELING_V2_GDN_INPROJ_NVFP4, TRTLLM_MODELING_V2_MTP_MOE_NVFP4 and TRTLLM_MODELING_V2_MTP_HEAD_NVFP4.
    • Concurrency 1 and 256, as before.

Moved out of this PR

These changes were taken out after review, or replaced by main. The executor, pyexecutor/engine/runners/decoder/ and pyexecutor/kv_cache/ files are identical to main in this PR.

  • Fused speculative bookkeeping (fused_accept.py, draft_loop_ops.py):
  • Steady-state verify prepare fast path (decoder/inputs.py):
  • One-launch decode metadata for QSA rows and GDN replay work items:
  • GDN cached-replay commit switch (modules/fla/cache_manager.py, modules/qwen4_exp/cache_manager.py): dropped.
    • It let the target's CuTe replay kernel commit every wrapping checkpoint itself, at every batch size, with the manager's all-layer commit switched off.
    • The CuTe kernel now follows main's contract instead, as the Triton kernel does: it commits in-kernel below 16 decode requests, and from there on the manager's all-layer commit does it.
    • So the runtime needs no change. In a paired A/B on one node, against the switch, it measured flat or better: con1 849 vs 838 tok/s/user; con32 4,624 vs 4,628 tok/s; con256 9,364 vs 9,329 tok/s.
  • Spec metadata: one pinned upload for the RNG buffers, and a cache of the sampling-parameter normalization: dropped. Main's sampling-scan cache covers the normalization.
  • Shared CuteDSL MoE finalize-fused GEMM options (moe/kernels/blackwell/): forked into the target instead. The shared kernel is as on main.
  • Debug and experimental switches:
    • TRTLLM_MODELING_V2_MTP_UNFUSED, TRTLLM_MODELING_V2_MTP_DRAFT_HEAD and TRTLLM_MODELING_V2_MTP_DRAFT_VOCAB are removed.
    • So is the code only they reached: the composed draft layer, the bf16 draft head and the draft-vocabulary slice.
  • TLLM_WORKER_USE_MP_PROCESS (executor/executor.py, executor/utils.py): dropped.
    • It runs a TP1 worker in a spawned process without MPI. It only matters in containers that forbid MPI_Comm_spawn, where the alternative is TLLM_WORKER_USE_SINGLE_PROCESS=1.
    • Against that alternative it measured +1.2% (con32) and +7.0% (con256) for STP.
  • Single cache refresh after the overlap scheduler's KV-length correction (decoder/inputs.py): dropped.
    • on_update_kv_lens() runs before and after the correction, as on main.
    • On this target that is one extra QSA row-mapping launch, about 4 µs, per captured MTP step.
  • V2 Mamba / GDN replay bookkeeping folded into the conv-state promotion (kv_cache/mamba_cache_manager/common.py): dropped.
    • Without it, each captured MTP step keeps 14 more graph nodes, about 21 µs.

Target kernels left out after review. Each one measured within serving noise, or below 2% at a single point:

  • Small-row NVFP4 MoE (nvfp4_moe_gemv, opt-in TRTLLM_MODELING_V2_MOE_GEMV): +1.6% at STP con1, used only there; MTP3 con1 within noise.
  • FP8 activation maximum folded into its producers (fused_sigmoid_mul_inplace, rms_norm_gated_token_major; only under TRTLLM_MODELING_V2_DENSE_FP8): MTP3 +0.9% at con32 and +1.3% at con256; STP within noise. The producers are as on main again, and the FP8 GEMM computes its own maximum.
  • Request-tiled verify index scores (qsa_paged_index_scores_verify): a gain only at the kernel level; serving pairs were within noise (MTP3 con32 −1.1%, con256 flat).
  • CuTe plan kernel for the prefill row-tile pass: about 0.2% of a prefill step. The Triton plan remains.
  • Lean one-split NVFP4 decode kernel: below 0.3% of a 256-row decode step; serving pairs were within noise.
  • Hyper-connection first-site weight-load hold (TRTLLM_HC_FIRST_WEIGHT_DELAY_NS, off by default): slower in the full STP decode step (con1 412.5 → 399.0 tok/s/user when on).

Review follow-ups

  • NVFP4 context scratch: bounded by the 128 MB budget above.
  • Rollback restore test (test_modeling_v2_qsa_rollback_planes.py): rejects every other row, so every cell both restores and keeps slots.
  • Shared code:
    • The MoE kernel is forked into the target.
    • The QSA and GDN metadata changes moved to their own PR.
    • The speculative bookkeeping is main's.
  • NUMA placement of the PLE table: NVML's CPU affinity instead of sysfs.
  • Unit tests trimmed: about 90 parametrized cases fewer across 12 files. Parametrization is narrower; every op's cells, guards and graph-replay checks stay.

PR Checklist

  • PR description clearly explains what and why.
  • PR follows the TRT-LLM coding guidelines to the best of my knowledge.
  • Test cases are provided for new code paths.
  • No API changes. The new opt-in switches are environment variables read by the target.
  • No new dependencies.

Merge Risk: Low · up to fa03b

The change adds SM103-specific kernels and a Triton greedy-argmax path. The open concerns are mainly missing GPU or architecture skips in tests, a few weak test assertions, and a formatting hook failure. These can break CPU-only or non-SM103 test collection and CI checks, but they are unlikely to affect production behavior. Fix them or explicitly accept them before merging.

Test abort while work is running.

Test nonblocking shutdown with an active worker.

The supplied change does not identify a test for shutdown(wait=False). Add an executor-session unit test with a blocked task. Assert that shutdown returns before the task completes and that the task can subsequently finish. This catches an accidental return to waiting shutdown. Capture and replay the folded V2 path.

The new test only toggles is_cuda_graph and runs one update on a fresh manager for each case. It does not capture a CUDA graph or replay it with changed accepted counts. Add a CUDA-gated capture-and-replay case in tests/unittest/_torch/executor/kv_cache/test_mamba_cache_manager.py. Check convolution state, prev_num_accepted_tokens, and cache_buf_idx after each replay. This can catch capture-only failures and stale replay bookkeeping.

tensorrt_llm/_torch/pyexecutor/engine/runners/decoder/inputs.py: 1

1068-1094: Trivial · Functional Correctness · Heavy lift

Add a regression test for the steady-state speculative verify fast path.

This change adds _record_steady_spec_cache, _can_use_steady_spec_fast_prepare and _apply_steady_spec_fast_prepare. The fast path rebuilds the inputs and metadata of a full pass from cached state. None of the listed tests exercises this path. A missed field can silently diverge from the full pass, for example:

  • previous_kv_lens_offsets
  • num_extra_kv_tokens
  • use_full_generation_page_table
  • spec_metadata.request_ids
  • the one-hot placeholder rows

The result would be wrong positions or KV lengths in graph replay.

Suggested minimal test, under tests/unittest/_torch/executor/:

  1. Use a DecoderInputPreparer with a linear-tree one-model spec config and the overlap scheduler enabled.
  2. Run two consecutive verify-only steps with the same requests and slots. The first step records the cache; the second step takes the fast path.
  3. Run the second step again with _steady_spec_cache = None to force the full pass.
  4. Compare input_ids_cuda, position_ids_cuda, draft_tokens_cuda, previous_pos_id_offsets_cuda, previous_kv_lens_offsets_cuda, kv_cache_params and spec_metadata.seq_lens between the two runs.
  5. Add a negative case: a changed slot, a changed verify width, or a request with py_needs_onehot_draft_probs must fall back to the full pass.

As per path instructions: "For each new or materially changed observable behavior, determine whether this PR adds, updates, or clearly identifies an existing test that meaningfully exercises the change."

[P1] This breaks the GLM-5.2 modeling_v2 target's MTP path.

eagle3.py:648 now always passes fused= to _prepare_next_new_tokens. But MTPDraftWorker in glm_moe_dsa/glm_5_2_nvfp4__sm_107__tp16/modeling.py:1587 overrides that method with the old 5-argument signature. That target is already on main via #20517, and it inherits _forward_impl through MTPEagleWorker.

As a result, GLM-5.2 NVFP4 on SM107 TP16 with MTP-Eagle raises TypeError: _prepare_next_new_tokens() got an unexpected keyword argument 'fused' on the first step, during warmup. By then auto has already selected the target, so there is no fallback. Pre-merge CI doesn't run this configuration.

Fix: make the override accept fused: bool = False and forward it to super()._prepare_next_new_tokens(..., fused=fused). No other override of this method exists in the repo.

Runtime part (speculative/): no value bug found. In the Triton interpreter, greedy_argmax, fused_accept.strict_accept, draft_row_select and next_new_tokens matched the ops they replace (ties, NaN, +-0, index wrap, mrope). But this conflicts with main. #20815 already added fused_accept.py with fused_strict_accept (forced acceptance, one launch) and step0_epilogue (draft_row_select plus the last accepted token for next_new_tokens). Main gates step0_epilogue per model via spec_decode_fast_paths; here draft_row_select is on for every MTP-Eagle model. Could you rebase onto main's kernels and keep only greedy_argmax? The auto-merged interface.py imports both fused_accept APIs (L37 here, L50 on main). If fused_accept.py:75-76 stays: with num_warps=4, a late warp can read the counter after thread 0 stored it. Main uses one warp.

@JunyiXu-nv Thanks for checking the numbers. I rebased onto main's kernels and dropped ours, keeping only the greedy argmax, and this model now opts into main's fast paths. So the warp note doesn't apply anymore.

@Barry-Delaney Thanks for catching that. After rebasing onto main's draft-loop code, this PR doesn't change that function anymore, so the GLM path is left as it is on main.

Add a regression test for compact IndexShare capture.

The existing mixed-batch test covers only compact=False. Add a GPU unit test that calls _capture_selection(..., compact=True) with mixed context and generation requests, then compares qsa_shared_topk_indices with the expected compact selection rows. This test must exercise both the context-row rewrite and the generation-row offset.

Add an isolated side-stream regression test.

The certified-cell tests cover only the current-stream branch. The whole-model prefill test executes the production side-stream path, but its breakable-versus-eager comparison uses that same path in both runs. A missing or reordered wait can therefore affect both runs without being isolated. Compare the side-stream result with the current-stream result for representative row counts.

…ecoding

The greedy target tokens and the greedy draft tokens of one-model speculative
decoding take greedy_argmax, a Triton row argmax, where they took
torch.argmax:
- Large inputs (at least 4M logits): each row is reduced in chunks, then the
chunks are combined. torch.argmax reads 248320-wide fp32 rows well under the
HBM rate (GB300, graph replay: 76 us at 256 rows).
- 1 to 16 rows inside a CUDA graph: two short launches instead of a memset and
  a 31-block reduce (GB300, 248320 fp32 columns: 2.4-5.0 us against
  10.6-16.4 us).
Other inputs keep torch.argmax.

The result equals torch.argmax element for element: NaN ranks first, equal
values resolve to the lowest index, and an all -inf row returns 0. The test
runs in l0_b200.

…into the one-engine speculative fast paths

The engine read spec_decode_fast_paths only from SpecDecOneEngineForCausalLM.
A model that builds its own draft model and spec worker, as Modeling V2
targets do, could not opt in. The engine now reads the flag from any language
model, so such a model opts in by setting it and passing it to its spec worker.
Nothing changes for a model that does not set it.

…timizations for ISL 8K / OSL 1K

Performance work on the qwen3_8_flash_next_nvfp4__sm_103__tp1 modeling_v2
target over the ISL 8192 / OSL 1024 Pareto curve on one GB300 (TP1, NVFP4 KV
cache, bf16 SSM state), for STP and MTP3: target-local ops (CuTe DSL, Triton),
each with a GPU test, wired into the target.

Decode at small batch
- Hyper-connection sites: faster 1-row kernels; 2..16 rows on a tensor-core
launch pair with the MoE finalize folded in; tc_first up to 256 rows.
- FP8 W8A16 GEMV (fp8_gemv) for the dense projections under dense FP8, the
vocab head, and the 1-row output and shared-expert projections.
- GDN: the in_proj GEMV with a fused conv1d epilogue (2..16 verify rows, up
to 8 decode rows); decode rows that stage the state by TMA; opt-in NVFP4
  in_proj up to 8 rows.
- NVFP4 sparse GQA decode on a CuTe split-K + merge kernel, behind a fused
  decode prologue over NVFP4 KV.
- MoE: pinned trtllm-gen tactics for the decode buckets; a tactic this build's
runner does not list as valid falls back to the AutoTuner with a warning.

MTP
- The draft step runs on the trunk's fused machinery and carries only the
draft loop's rows; an FP8 lm_head copy serves the draft head; opt-in NVFP4
  draft head and draft-layer experts.
- The engine's one-engine speculative fast paths: the draft loop's step-0
epilogue, the recorded steady decode-step prepare and the overlap loop on
  the execution stream.
- Verify: request-grouped NVFP4 sparse GQA (coalesced gated epilogue, split
  last wave, per-row merge, every reachable launch plan compiled up front);
  the GDN cached-replay verify on a CuTe tensor-core kernel over a bf16
state, under the same checkpoint-commit contract as the Triton kernel.
- One-launch speculative rollback (spec_rollback_commit) and decode-step
setup (verify_step_setup); batched rollback of the QSA index planes; fused
PLE on verify and mixed steps.

Prefill and mixed steps
- Faster prefill CuteDSL MoE: one-launch routing and sort, pinned tactics,
and FC2 on the target's own copy of the finalize-fused grouped GEMM with an
  MMA K tile, a row-owned epilogue and L2 cache hints. Opt-in per-tensor FP8
dense projections; tcgen05 dense projections for 17..256 rows
  (mid_rows_mm).
- HC sites without a stored normed stream; a leaner GDN prefill block.
- The sparse attention row-tile pass is persistent and free of per-step
Triton recompiles; NVFP4 KV context pages are dequantized into a bf16
scratch, a group of context requests at a time within 128 MB.
- The PLE host table lives on the GPU's NUMA node (NVML's CPU affinity).

Opt-in switches: TRTLLM_MODELING_V2_DENSE_FP8, TRTLLM_MODELING_V2_GDN_INPROJ_NVFP4,
TRTLLM_MODELING_V2_MTP_MOE_NVFP4 and TRTLLM_MODELING_V2_MTP_HEAD_NVFP4.

GB300, ISL 8K / OSL 1K, from the NVFP4 KV + bf16 state starting point (con1
tok/s/user; con32 and con256 tok/s/GPU): STP 349 -> 451, 2,907 -> 3,378,
5,986 -> 7,448; MTP3 at a forced acceptance of 3.3: 425 -> 857,
3,570 -> 5,552, 4,957 -> 10,148. These were measured with a few kernels
since left out (the small-row NVFP4 MoE at STP con1, the FP8 activation maximum
folded into its producers, request-tiled verify index scores, a CuTe plan
kernel for the row-tile pass, a lean one-split decode kernel), each within
measurement noise or below 2% at one point, and with runtime changes this
commit no longer carries. Accuracy on this revision: gsm8k STP 95.94, MTP1
95.79 (acceptance 1.970, MMMU 58.44), MTP3 over CuteDSL experts, fp8 KV and
a bf16 state 96.25 (acceptance 3.508); the MTP3 and MTP7 long-context
pass-key cases pass (acceptance 3.998, 6.967).

…et's fastest MTP3 configuration

The modeling_v2 MTP3 case now runs with an NVFP4 KV cache and a bf16
recurrent state, and with the target's opt-in fast paths: FP8 dense
projections, the NVFP4 GDN input projection for decode rows, and NVFP4
copies of the MTP draft layer's routed experts and of the draft head.
Concurrency 1 and 256 as before; acceptance stays unpinned.
